Not quite the same as "guilty pleasures" (which always seem to include Bonnie Tyler and Phil Collins), which songs do you secretly love/like which would not be seen as credible at all?

Mine:

Bucks Fizz - My Camera Never Lies

Bardo - One Step Further

Doctor Spin - Tetris

Nolans - Gotta Pull Myself Together

Nolans - Attention To Me

Dollar - Who Were You With In The Moonlight

Modern Romance - Walking In The Rain

Will To Power - Baby I Love Your Way - Freebird

Scatman John - Scatman

Well, there's a few. Yes, some are quite shameful

I have two Naff classics that I absolutely adore by Britain's Most Successful Songwriter of All-Time & arguably Britain's Greatest "Melody Maker" and Britain's Greatest & Most Influential Male Artist of All Time:

Paul McCartney - We All Stand Together (1984)

David Bowie - Laughing Gnome (1967)

Both songs are so "out there" they make Radiohead's most uncommercial track seem like The Saturdays in comparison.
